Distributed Training Infrastructure

"Design the infrastructure for training a 500B-parameter model on a 4,000-GPU cluster. Cover the job submission, scheduling, checkpointing, failure handling, and the developer ergonomics. A single node failure should not kill a 3-week training run. Walk me through it."

1. Scope, Reframing, and What I’m Pushing Back On

Before any architecture: the question as posed is underspecified in a way that hides the actual design pressure. Let me restate what I think you’re asking and commit to the assumptions that change the answer.

[STAFF SIGNAL: saying no] “A 3-week training run” is wall-clock framing. The job ends when the token budget is hit, not when the calendar runs out. For a 500B-parameter dense model trained on a frontier token budget (~5T tokens) at ~50% MFU on 4,000 H100s, the run is ~70–90 days, not 21. If “3 weeks” is a hard requirement, either the cluster is too small, the model is smaller, or the token budget is far below frontier. I’ll design for the realistic case — a ~70-day run on 4,000 H100s — because the failure-budget arithmetic is the architecture, and 3 months of failure exposure is a fundamentally harder problem than 3 weeks. The infra must survive 70+ days; if it does, 3 weeks is trivial.

[STAFF SIGNAL: saying no] “A single node failure should not kill the run” is the floor, not the goal. At 4,000 H100s over 70 days I expect ~140 unexpected interruptions (extrapolating from Llama 3’s published reliability data: 419 interruptions in 54 days on 16K H100s, ~78% confirmed hardware). The real bar is: the run survives a rack failure (32 GPUs lost simultaneously), survives correlated network-fabric incidents, and survives silent data corruption in any one of those 4,000 GPUs without invisibly poisoning the model.

That last row is where most candidates lose the plot. You don’t enter a 70-day run with all 4,000 GPUs in the training mesh. You enter with hot spares pre-warmed, NCCL-initialized into a parallel “shadow” world that can be promoted to replace a failed rank without re-allocating from the scheduler. More on this below.


2. Capacity, Memory, and Failure-Budget Math

Activations (selective recomputation, 8K seq, ~120 layers): empirically ~80–120 GB per pipeline stage per micro-batch in flight. With p=8 and 1F1B, peak in-flight micro-batches per stage is bounded by p, so peak activation memory at stage 0 is ~p × ~100 GB = 800 GB per stage across the TP group → ~100 GB per GPU after TP=8 sharding. This is the dominant memory pressure at stage 0.

H100 has 80 GB. We’re at 80–95% utilization, which is the right operating point — any lower and you’re leaving compute on the table; any higher and you’re one OOM away from a crash on a long-tail step.

[STAFF SIGNAL: parallelism math] This memory budget is why TP=8 × PP=8 instead of full FSDP. Pure FSDP/ZeRO-3 across all 4,000 GPUs would shard weights 4,000 ways but force an all-gather of every parameter on every forward, which the inter-node IB cannot sustain at this size. 3D parallelism keeps weights local within TP+PP groups and only pays DP communication for gradient reduce-scatter (ZeRO-1).

Total training FLOPs ≈ 6 × N × D = 6 × 5×10¹¹ × 5×10¹² = 1.5 × 10²⁵ FLOPs.

Per-GPU effective throughput at MFU 50% on H100 (BF16 peak 989 TFLOPS): ~495 TFLOPS. With FP8 on dominant GEMMs: realistic effective ~650 TFLOPS (measured against BF16 baseline).

Cluster effective: 3,968 × 650 TFLOPS = 2.58 EFLOPS.

Wall-clock active compute: 1.5 × 10²⁵ / 2.58 × 10¹⁸ = 5.81 × 10⁶ s = ~67 days. With ~5–8% downtime budget → ~72-day end-to-end run.

Llama 3 paper: 419 unexpected interruptions in 54 days on 16,384 H100s = ~7.8 events/day for a 16K cluster ≈ 4.8 × 10⁻⁴ events/GPU/day. At 4,000 GPUs × 72 days: ~138 expected interruptions. 78% confirmed hardware (58.7% GPU-related).

Recovery-time math:

  • Mean recovery 10 min (with hot spares) → 138 × 10 min = 23 hours = 1.3% of run.
  • Mean recovery 30 min (no hot spares, scheduler reissue) → 69 hours = 4.0% of run.

[STAFF SIGNAL: failure-budget reframing] This is the entire reason hot spares exist. The architecture’s job is to keep recovery time below 10 minutes per event. 1.3% loss is acceptable; 4.0% is an extra 3 days of compute on a 72-day run, which at internal cost (2/H100hour,4,000GPUs, 3days)is 2/H100-hour, 4,000 GPUs, ~3 days) is ~575K of waste per run. That’s the budget for engineering this right.

[STAFF SIGNAL: blast radius reasoning] Failure-domain boundaries:

  • GPU-level: ECC errors, PCIe drops, thermal throttle. Detect → quarantine GPU → fail node.
  • Node-level: NIC failure, kernel crash, NCCL deadlock localized to one host. Detect → swap node from hot-spare pool.
  • Rack-level: ToR switch failure, PDU drop. Detect → restart from checkpoint, lose 16–32 GPUs (multiple nodes) until rack recovers; if total active GPU count drops below threshold, the run pauses rather than reduces world size mid-run (see elastic-training rejection below).
  • Fabric-level: spine switch failure, ECMP imbalance, congested rail. Detect → NCCL-level retry, possibly route around; if persistent, restart.

Anything cross-cutting (a bad data shard, a buggy commit) cannot be solved by hardware redundancy — it’s solved by the bit-reproducible-resume contract and the SDC detection layer.


4. Parallelism Strategy: Committed Configuration

Final commitment: TP=8 × PP=8 (interleaved 1F1B, v=2) × DP=62 with ZeRO-1 optimizer-state sharding across DP, FP8 GEMMs via Transformer Engine.

TP=8 is forced by the NVLink boundary. Tensor parallelism does AllReduce on every transformer block (twice per layer: attention + MLP). NVLink bandwidth is ~900 GB/s/GPU; cross-node IB is ~50 GB/s effective per GPU. Crossing the node boundary on TP would slow each transformer-block AllReduce by ~18×, dominating every step. TP=8 is the maximum that fits in the NVLink island for H100.

(On GB200 NVL72 the NVLink domain is 72 GPUs, and TP=64 or TP=72 becomes feasible. [STAFF SIGNAL: modern awareness] This inverts the parallelism shape — a 500B model could fit weights+optstate inside a single NVL72 with TP-only, eliminating PP. The tradeoff math here would be redone end-to-end.)

PP=8 is chosen so each pipeline stage holds ~15 layers’ worth of weights+grads+activation memory and fits in 80 GB after TP sharding. PP communication (point-to-point send/recv) is small, latency-tolerant, and trivially overlapped with compute. The cost is the bubble.

DP=62 absorbs the rest. ZeRO-1 (optimizer-state sharding) gives the memory headroom for activations without paying the full ZeRO-3 communication cost (which would all-gather weights every step — fine on NVLink, ruinous across IB).

[STAFF SIGNAL: rejected alternative] Why not pure FSDP across 4,000 GPUs: pure FSDP shards 1 TB of weights across 4,000 GPUs (256 MB/GPU), but every forward and backward requires all-gather of each layer’s weights from all 4,000 ranks. At ~1 TB/step × ~100 steps/min that’s 100 TB/min of all-gather over IB. The fabric supports this only if perfectly hierarchical and overlapping with compute — but in practice FSDP-only at 4K H100 scale is dominated by collective wait time. 3D parallelism keeps the weight all-gather inside the TP=8 NVLink island, where it’s essentially free.

[STAFF SIGNAL: rejected alternative] Why not deeper PP, narrower DP: PP > 8 increases bubble and increases sensitivity to stragglers (one slow stage stalls the whole pipeline). PP=8 with interleaved 1F1B v=2 keeps bubble below 6%.

Why not context parallelism: at 8K sequence the activation memory is manageable inside TP=8. CP becomes mandatory at ~64K+ sequences.

Why not expert parallelism: dense model. If MoE: EP=8 across nodes, replacing one of the existing dimensions, with the load-balancing-loss and dispatch all-to-all becoming the new dominant communication pattern.

[STAFF SIGNAL: communication topology awareness] Critical placement: the DP groups (the columns) must be physically aligned with the IB rail topology. Each PP stage has 62 nodes that all-reduce together; if these 62 nodes are scattered across the cluster, every gradient AllReduce hits the spine switch, which becomes the bottleneck. The scheduler places each DP group on the same rail (or minimal-spine-hop subset), and the PP-axis send/recv uses a separate rail to avoid contention with DP reduce-scatter.

With p=8, m=64 microbatches per global batch, v=2 interleaved chunks per stage:

[STAFF SIGNAL: pipeline-bubble discipline] Why v=2 not v=4: each interleaved chunk increases activation memory by ~(v−1)/v factor and increases pipeline send/recv ops by v×. At v=4, activation memory at stage 0 exceeds the 80 GB ceiling under our chosen TP=8/PP=8 layout. Math: at 5.5% bubble on a 72-day run, that’s ~4 days of bubble. Going to v=4 (2.7%) saves ~2 days ≈ $1M of compute, but requires ~10 GB more activation memory per stage-0 GPU, which we don’t have. [STAFF SIGNAL: rejected alternative] Zero-Bubble PP (Sun et al. 2023) further reduces bubble by splitting backward into ∂L/∂x and ∂L/∂W passes scheduled independently — gain is ~3–4 percentage points, but requires substantial framework engineering atop Megatron-Core and isn’t yet proven at 4K-GPU production scale. I’d run it as a v2 optimization, not v1.


5.1 Checkpointing: cadence, format, throughput, durability

With sync_stall ≈ 10 sec (device → pinned host RAM, blocking), failure_rate = 138/(72d) = 2.22 × 10⁻⁵/sec:

interval* = sqrt(2 · 10 / 2.22 × 10⁻⁵) ≈ ~950 sec ≈ 16 minutes.

I’ll commit to 30-min cadence as a slightly conservative round number — it adds <1% over the optimum, and tooling/operational simplicity favors round numbers. At 30 min:

  • Failures × half-interval: 138 × 15 min = 34.5 hours = 2.0% of run (recompute on resume)
  • Sync stalls: (72d × 48 ckpts/day) × 10 sec = 9.6 hours = 0.55% of run
  • Total checkpoint overhead: ~2.5% of run

The dominant cost is not the cadence but the sync stall per checkpoint. With async checkpointing the sync stall is the time to copy state from device to pinned host memory (~5–15 sec for 8 TB sharded across 3,968 GPUs; each rank copies its ~2 GB shard in parallel at NVLink bandwidth). Background upload happens during training.

[STAFF SIGNAL: rejected alternative] Why not a single global torch.save: at 8 TB, a single rank-0 save would take hours and stalls all 3,968 GPUs. Naïvely sharded torch.save per rank produces 3,968 files with no consistent format and no manifest — recovery requires every rank to find its own file and hope the layout matches.

Format: PyTorch Distributed Checkpoint (DCP) or a thin custom layer over it. The contract: each rank writes its (TP_rank, PP_rank, DP_rank)-keyed shard with a manifest tying them together; recovery can re-shard if world size changes (rare for sync training but useful when restarting on a different cluster shape after fabric failure).

[STAFF SIGNAL: invariant-based thinking] Checkpoint invariant: at any wall-clock time, there exists a globally consistent checkpoint at some training step S, durable to at least Tier 2, such that loading it on any 3,968-GPU subset of the cluster reproduces the exact training state at step S. Enforced by atomic manifest commits — the manifest is updated only after all shards are written, so a partial checkpoint never becomes “current.”

5.2 Failure Detection and Recovery: End-to-End Timeline

[STAFF SIGNAL: failure mode precision] Specific failure modes I’m explicitly handling:

  1. Hard GPU failure (XID 79, etc.): timeline above.
  2. NCCL hang without explicit error: watchdog catches after timeout (tuned to 30s–5min depending on collective). Pathological case: a flaky link causes intermittent slowdowns that don’t trip the watchdog but slow the run by 30%. Detected by per-step time anomaly monitoring; response is to flag the suspect node for inspection.
  3. CUDA OOM at hour 200: usually activation memory fragmentation. Defense: explicit memory limits, expandable_segments in CUDA allocator, periodic torch.cuda.empty_cache() between epochs. If it happens, restart from checkpoint with memory profiling enabled.
  4. Rack failure (32 GPUs lost): hot-spare pool is 32 GPUs (4 nodes) — a full rack loss exhausts it. Response: pause the run, request more capacity from scheduler, restart when ≥3,968 GPUs available. The run survives the rack loss (state is durable in Tier 3), but it pauses rather than continues reduced.
  5. Object-store outage during checkpoint upload: Tier 1 (peer DRAM) and Tier 2 (NVMe) protect against this. The run continues; object-store upload retries until durable. Risk window is the time between Tier 2 and Tier 3 (~5 min).

[STAFF SIGNAL: rejected alternative] Elastic training (continuing with fewer ranks until replacement arrives): rejected for synchronous large-scale pretraining. Changing world size mid-run changes the global batch size, which changes optimizer dynamics — the loss curve shifts. For SFT/fine-tuning where the run is short and dynamics are forgiving, elastic is reasonable. For a 72-day pretrain, the cost of a non-bit-reproducible perturbation is too high. Pause-and-resume is the right answer.

5.3 Silent Data Corruption: First-Class, Not Theoretical

[STAFF SIGNAL: SDC as first-class] Meta’s “Detecting silent data corruptions in the wild” and the Llama 3 paper both confirm SDC at meaningful rates — typically 1 SDC per ~10⁹–10¹⁰ FLOPs at fleet scale, translating to multiple events per cluster-month. Google has published similar findings. SDC is not theoretical; an unmitigated 4,000-GPU 72-day run will see ≥1 SDC event in expectation.

Failure mode: a flaky GPU returns subtly wrong values for a matmul. Model continues training, gradient norms look fine on aggregate, loss looks fine, but the affected DP replica is contributing poisoned gradients into the AllReduce. Two days later loss starts diverging — or worse, doesn’t, and you ship a corrupted model.

Detection mechanisms (deployed in layers):

  1. Cross-DP gradient-norm anomaly detection: each DP replica computes the same gradient (modulo data); their norms should agree within a tight band. A replica with consistently outlier norm is suspect. Cost: free (norms computed anyway). FPR: high without smoothing — apply z-score over a sliding window.

  2. Periodic deterministic recompute: every ~1000 steps, on each PP stage, run the same forward pass on two TP groups within the same physical node and bit-compare outputs. Mismatch = SDC. Cost: ~0.1% of compute. Catches: persistent SDC in matmul, attention.

  3. End-to-end loss-curve anomaly detection: real-time z-score of training loss against smoothed baseline. Spikes that correlate with a specific replica’s checkpoints are suspect.

  4. Per-shard checksum on checkpoint: each TP×PP shard’s CRC stored in the manifest. On reload, mismatched checksum = corruption.

Response when SDC is detected: (a) quarantine the suspect node; (b) determine the SDC window — the latest checkpoint where the suspect node was not yet showing anomaly (use gradient-norm history to estimate when corruption began); (c) restore from a checkpoint before the SDC window; (d) replace from hot-spare pool; (e) resume.

The cost of undetected SDC is the failure mode that ends careers: the run might still converge, but the model quality is degraded, and the only way to discover it is downstream eval months later.

5.4 The Dataloader: First-Class Component, Not Footnote

Section titled “5.4 The Dataloader: First-Class Component, Not Footnote”

[STAFF SIGNAL: dataloader as first-class] The dataloader is on the critical path. If it stalls, 3,968 H100s idle at ~8K/hourtotal 8K/hour total ≈ ~2/sec wasted. There is no excuse for the dataloader being slow.

Architecture: Mosaic-streaming-style. Tokenized data lives in object store as shards (~100 MB each). Each DP rank streams its assigned shards; shard assignment is deterministic from (epoch, dp_rank, global_seed). Within a shard, samples stream in order. Cross-shard shuffle is achieved by interleaving multiple shards per rank.

Determinism contract: given (global_seed, current_step, dp_rank), the dataloader can reproduce exactly which sample is being served. Hard invariant — without it, resume is non-deterministic, SDC detection’s “compare to baseline” loses statistical power, and reproducibility for debugging is lost.

Resume: dataloader state (current shard, byte offset, sample counter) is checkpointed alongside model state. On resume, the dataloader is initialized at the saved position, not from scratch.

Failure modes I’ve seen in production:

  • Shard corruption: bad bytes cause a rank to crash on tokenizer error. Defense: per-shard checksum on read, fail-fast with rank-id and shard-id logged so the offending shard can be regenerated.
  • Slow storage: object-store throttling causes stalls. Defense: aggressive prefetching, multi-tier caching (warm shards on local NVMe), SLA-monitored backend.
  • Resume off-by-N: dataloader resumes but is now serving samples already trained on, or skipping samples. The most common subtle bug. Defense: deterministic indexing tied to (global_step, rank), not “count of samples yielded so far.” Tested explicitly with a “checkpoint, kill, resume, verify next batch matches” integration test.
  • Memory pressure: dataloader’s prefetch buffer competes with PyTorch. Defense: hard memory cap on dataloader, pinned-memory-only allocation.

5.5 Communication and Topology Optimization

Section titled “5.5 Communication and Topology Optimization”

[STAFF SIGNAL: communication topology awareness] The IB fabric matters. A 4,000-GPU cluster is typically a fat-tree or Dragonfly+ Clos with rail-optimized topology. Each H100 node has 8 NICs (one per GPU), each on a separate rail. Cross-rail traffic hits the spine; same-rail traffic stays local.

Collective patterns:

  • TP collectives (intra-node, NVLink): ring AllReduce, ~5 GB/s effective per GPU pair. Essentially free.
  • DP gradient ReduceScatter / AllGather (62 nodes, inter-rack): hierarchical — within rail first, then across rail. NCCL 2.18+ does this with NCCL_ALGO=Tree,Ring and NCCL_PROTO tuning. SHARP (in-network reduction on Quantum-2 IB) aggregates in switch hardware — gain of ~30–50% on AllReduce at this scale, well worth enabling.
  • PP send/recv: point-to-point, latency-tolerant, overlaps trivially with compute.

Gradient bucketing for overlap: PyTorch’s DDP-style bucketing groups gradients into ~25 MB buckets; ReduceScatter starts as soon as a bucket is filled during backward. Tune bucket size to match latency × bandwidth product: smaller buckets = better overlap, more collective overhead. ~25–50 MB is the sweet spot.

Failure mode: one slow link: a single degraded IB link (CRC errors, slow port) silently slows every collective the link participates in. Detection: per-step time anomaly + per-link counters. NCCL has hooks for per-link timing. Response: route around (NCCL ring re-formation), or quarantine the node on that rail.

[STAFF SIGNAL: invariant-based thinking] Operational invariant: in steady state, MFU ≥ 50% (BF16-equivalent). A sustained drop below 45% means communication is leaking — debug topology placement, NCCL tuning, link health. MFU is the alarm metric.

Loss diverges at hour 200 of a 1700-hour run. Was it the data, the optimizer, hardware, numerics, or architecture?

Detection:

  • Real-time loss z-score over a 1000-step sliding window.
  • Gradient norm tracker (a spike in pre-clip gradient norm precedes loss divergence by tens of steps).
  • Update norm tracker (post-optimizer; reveals optimizer pathologies).
  • Activation norm tracker per layer (catches numerical issues like attention-logit blowup, common at low precision).

Response (human-in-the-loop):

  1. Pause run (don’t kill).
  2. Investigate: is the spike correlated with a specific data window? A specific replica (suggesting SDC)? Architecture-level (e.g., a specific layer’s grad-norm anomalous)?
  3. If data: skip the window, resume from pre-spike checkpoint, log offending shard for inspection.
  4. If SDC: see SDC response.
  5. If architecture/numerics: rewind to pre-spike checkpoint, restart with adjusted LR (lower) or adjusted clip threshold.
  6. If unclear: rewind further, more conservative restart.

[STAFF SIGNAL: modern awareness] Architectural choices that mitigate spikes: gradient clipping (global norm ~1.0), LR warmup (~2000 steps), careful initialization (μP or scaled init), loss scaling for FP16/FP8 (delayed scaling on Transformer Engine), z-loss for output logits (prevents numerical drift in softmax). References: Bloom paper’s exhaustive instability documentation, OPT-175B’s logbook, Llama 3’s spikes section.

The cost of a missed spike is days of training thrown away. The cost of being too aggressive in pausing is also days thrown away. The judgment is what makes this a human in the loop, not full automation. Automation flags; humans decide.

5.7 Developer Ergonomics and Observability

Section titled “5.7 Developer Ergonomics and Observability”

[STAFF SIGNAL: developer ergonomics] The infrastructure exists to serve research engineers. If only the on-call SRE can launch a job, the infrastructure is broken regardless of how good the failure recovery is. This is the section most candidates skip and most interviewers who’ve actually run these systems care about.

Submission interface: config-as-code (Python config dataclasses or YAML), with reproducibility metadata embedded:

  • Git SHA of training repo
  • Container image digest
  • Dataset version and shard manifest hash
  • Random seed
  • All hyperparameters

A run is launched with train submit config.yaml. The submission system validates the config against a schema, reserves the GPU slice (gang-scheduled), pre-warms the hot-spare pool, and writes a run-record to experiment tracking.

Live observability:

  • MFU as a first-class metric (not GPU utilization — utilization can be 100% while doing useless work; MFU measures actual training throughput as a fraction of peak).
  • Loss curves per replica (to catch SDC).
  • Per-rank step time (to catch stragglers).
  • Gradient and activation norms.
  • GPU memory headroom (alarm at < 5 GB free).
  • Per-link IB counters.
  • Distributed traces for slow steps (which collective is slow?).

Debugging surface:

  • Attach a debugger to one rank without disturbing others.
  • “Shadow forward”: run the same forward on rank 0 and rank N, bit-compare (SDC debugging or numerical investigation).
  • Save partial state for offline replay.
  • Step-level loss reproduction from any checkpoint.

Experiment tracking: W&B or internal equivalent, integrated end-to-end. Every run, every metric, every config. Searchable. This is how research engineers find prior runs to compare against.

5.8 Cluster Scheduling and Hardware Fungibility

Section titled “5.8 Cluster Scheduling and Hardware Fungibility”

A 4,000-GPU job is a heavyweight tenant. If the cluster is shared (which at frontier labs it usually is, even for production training):

  • Gang scheduled: all 4,000 GPUs allocated atomically, or none.
  • Topology-aware placed: the scheduler must place ranks to respect rail/rack topology.
  • High priority: can preempt smaller jobs to acquire the slot.

Queueing reality: a 4,000-GPU slot may take days to clear. Pre-warming strategy: start the run on whatever capacity is available for a “bring-up” phase (smaller batch, debug runs), then scale to full when the slot clears.

[STAFF SIGNAL: rejected alternative] Kubernetes-native (Volcano, Kueue, Run.AI) vs Slurm: Slurm remains standard at frontier labs and is more battle-tested for synchronous large-scale training. K8s has matured but introduces additional moving parts at the orchestration layer. I’d choose Slurm + custom orchestration sidecar over pure K8s. Ray Train and SkyPilot are reasonable for the smaller-scale R&D fleet but aren’t the right fit for the 4,000-GPU production run.


[STAFF SIGNAL: modern awareness] FP8 on H100 (Transformer Engine, delayed scaling) is real and worth deploying:

  • All linear-layer matmuls in FP8 (E4M3 forward, E5M2 backward).
  • LayerNorm, attention softmax, optimizer math, loss computation in BF16/FP32.
  • Per-tensor scaling factor maintained with a window of recent amax values (delayed scaling — avoids the cost of computing amax on the current tensor).
  • Calibration phase at start of training to establish scaling factors.

Quantification: ~1.4–1.6× wall-clock speedup at 500B scale (matmuls dominate). Engineering cost: numerical care in calibration, monitoring tensor-statistic drift, fallback to BF16 on layers that don’t tolerate FP8. The Llama 3 paper documents the recipe.

The numerics are sensitive to format choice — FP8 E4M3 has a ULP of 0.125 at unity vs BF16’s ~7.8×10⁻³. The 16× resolution drop is acceptable for matmul intermediates because the rounding noise is dominated by the FP32 accumulator, but it’s not acceptable for accumulation itself or for sensitive operations (LayerNorm statistics, optimizer second moment). MXFP4/MXFP8 on Blackwell extends this with per-block scaling instead of per-tensor — changes framework integration but not architecture.


[STAFF SIGNAL: invariant-based thinking] Bit-exact resume is the contract; non-determinism is the enemy.

Sources of non-determinism:

  • NCCL collective order (mitigated by NCCL_ALGO pinning at performance cost).
  • Atomic accumulator reordering on GPU (matmul reduction order non-deterministic with TF32 and similar; mitigated by deterministic kernels at ~10–30% perf cost).
  • Dataloader shuffle (covered above; deterministic by construction).
  • FP8 amax history (delayed scaling state must be checkpointed).

For production pretrain, I accept near-deterministic resume (loss curves match within numerical noise), not bit-exact. For debugging-grade reproducibility (chasing a specific spike), I’d run with deterministic-mode flags accepting the ~20% performance hit. This is a deliberate tradeoff, not an oversight.


8. Recent Developments and Why They Matter

  • Llama 3 paper (Meta, 2024): published reliability data — single best public source on 16K-H100 failure rates. Drives my failure-budget arithmetic.
  • FSDP2 (PyTorch): per-parameter sharding (vs FlatParameter), better composability with TP. Used for the ZeRO-1 layer.
  • Megatron-Core: production framework for 3D parallelism with interleaved 1F1B. Reasonable starting point; usually needs a custom extension layer for checkpoint format and orchestration.
  • TorchTitan: PyTorch-native large-model training reference. Cleaner than Megatron, less battle-tested at 4K+ scale.
  • Zero-Bubble PP (Sun et al., 2023): bubble reduction technique I rejected for v1, would deploy for v2.
  • FlashAttention-2/3: cuts activation memory ~5×, lets us fit longer sequences or larger micro-batches.
  • Transformer Engine (NVIDIA): FP8 with delayed scaling, integrated with Megatron.
  • SHARP (NVIDIA Quantum IB): in-network AllReduce, ~30% gain at this scale.
  • Mosaic Streaming / Composer: streaming dataloader with deterministic resume — solid reference design.
  • Async checkpointing in FSDP / DCP (PyTorch): production-grade async checkpoint primitives.

9. Tradeoffs Taken and What Would Change Them

Section titled “9. Tradeoffs Taken and What Would Change Them”
  • MoE instead of dense: EP enters; parallelism becomes 4D (TP × PP × EP × DP). Communication shifts from AllReduce to all-to-all (much more punishing on IB). Token routing imbalance becomes a top-2 design pressure.
  • Long context (1M tokens): CP becomes mandatory, replacing one of the existing dimensions. FlashAttention with sequence parallelism (Ring Attention) is the implementation.
  • GB200 NVL72 hardware: TP=64 within a single NVLink domain; PP can be eliminated for a 500B model since weights + opt-state fit. Parallelism collapses to TP × DP. Whole architecture re-thought.
  • Smaller cluster (1,000 H100s): pipeline depth increases; ZeRO-3 might re-enter as the only way to fit the model.
  • RLHF rather than pretrain: rollout serving + reward model + actor + critic + ref model = 4-model coordination problem; a fundamentally different system, not a parallelism re-config.

[STAFF SIGNAL: saying no]

  1. “Single node failure should not kill the run” — floor, not goal. The bar is rack-level survivability with bounded recovery time.
  2. “3-week run” — wrong frame. The run ends when the token budget is hit. At 4,000 H100s and a frontier token budget, that’s ~70 days. Designing for 3 weeks misses the failure-rate scaling.
  3. “4,000 GPUs is the cluster size” — derived from what token-throughput target? A 500B dense model at compute-optimal token budget might want 8,000+ GPUs to finish in <60 days, or 2,000 GPUs and patience. The right cluster size falls out of (token budget × MFU × wall-clock target), not the other way around.
  4. Developer ergonomics framed as a separate concern — it’s central. Bad ergonomics → research velocity collapses → cluster TCO is wasted on a system nobody can iterate on.
  5. Implicit assumption that this is one job. In reality, the cluster runs production training, debug runs, ablations, and evals concurrently. The infrastructure has to multiplex; the design above is for the dominant tenant, with the assumption that an underlying scheduler handles multi-tenancy.

The architecture is a 3D parallelism layout (TP=8 × PP=8 × DP=62 + ZeRO-1) with interleaved 1F1B pipelining, async tiered checkpointing at 30-min cadence, hot-spare nodes pre-warmed in a NCCL shadow world for sub-10-minute recovery, layered SDC detection (gradient-norm anomaly + periodic deterministic recompute + checkpoint CRCs), a deterministic streaming dataloader with checkpointed state, hierarchical NCCL collectives with SHARP, FP8 GEMMs via Transformer Engine, and an observability stack centered on MFU as the operational invariant. The total checkpoint+failure overhead is budgeted at ~3.3% of the 72-day run, and the architecture survives any single GPU, node, or rack failure with the run resuming automatically. The thing that’s most likely to actually break the run is silent data corruption — handled as a first-class concern, not an afterthought.
